Standard instruct LLMs fail on downstream structured extraction pipelines in three distinct ways:
- Conversational Pollution: Prepending conversational chatter ("Sure! Here is the JSON...") or markdown fences (
json ...) that break machine APIs. - Hallucination on Missing Entities: Fabricating missing schema properties rather than gracefully failing.
- Over-refusal: Rejecting valid inputs due to superficial messiness in input text.
This repository implements a two-phase curriculum to solve these failure modes:

| Step | Technique | VRAM Needed | Recommended Hardware | Time (1k samples) |
|---|---|---|---|---|
| Phase 1: SFT | QLoRA (NF4 4-bit, rank=32) | ~12.5 GB | 1x RTX 3090, 4090, or A10G | ~18 mins |
| Phase 2: DPO | QLoRA + Adapter Disable Ref | ~13.8 GB | 1x RTX 3090, 4090, or A10G | ~25 mins |
| Inference (Merged) | bfloat16 Full Weights | ~16.0 GB | 1x A10G / A100 (or 8-bit quantized) | <30ms / tok |
VRAM Optimization Insight: Standard DPO requires loading both the policy
$\pi_\theta$ and reference model$\pi_{\text{ref}}$ , typically consuming >32GB VRAM. In our implementation (src/train_dpo.py),ref_model=Noneinstructs TRL to evaluate the reference policy by dynamically disabling the LoRA adapter inside atorch.no_grad()context, eliminating the need to duplicate base model weights in VRAM.
