feat(prims-ts): expose merge-compatible softmax statistics for prefill and decode - #5489
Expose merge-compatible softmax statistics for PrimTS contiguous/paged prefill, paged FMHA decode, and paged MLA decode. Add per-query MLA KV bounds for distributed attention and preserve the independently reviewable, validated MLA scheduling optimizations used by NVIDIA/TensorRT-LLM#19395.
plan(store_softmax_stats=True) selects the compiled specialization; run(softmax_stats=...) binds caller-owned request storage. One-shot entry points and workspace-size helpers follow the same contract. Existing output returns and current-main LSE APIs are preserved.
The contiguous FP32 statistics buffer has shape [*out.shape[:-1], 2] and stores (m, s): maximum scaled token logit in natural-log units and sum(exp(logit - m)). Statistics remove internal FP8 probability scaling. Decode sinks contribute once to the denominator without changing the token maximum.
Export final statistics through direct, fused, cluster, and standalone split reductions, including MLA 1-CTA and 2-CTA kernels. Centered arithmetic preserves the maximum/denominator merge contract for large finite scores.
Preserve zero output and (-inf, 0) statistics for supported empty local partitions. Per-query MLA bounds support Helix local attention spans and CUDA-graph replay.
Keep statistics disabled by default. Current-main behavior is preserved when statistics are disabled, except for the separately identified performance commits. Existing LSE, runtime scales/lengths, scheduler, and launch-spec interfaces are retained.
Keep the optional statistics output merge-compatible: statistics-enabled context uses exact maximum updates rather than lazy correction, and FP32 exponent/reduction behavior where needed. Unsupported statistics combinations fail explicitly instead of silently returning an incompatible state.
Review order and upstream adaptation
The eleven signed commits at 005d91701b95e88a3495da84e6d384efccc606d7 separate functionality, performance, and follow-up correctness/test fixes:
b2d1bb78c: contiguous-context statistics.
ac49228fe: rename the option to store_softmax_stats.
188d87bbc: paged prefill, standard decode, and MLA statistics, adapted to current-main APIs.
ebc9792b4: per-query MLA KV bounds.
4c4e4a03e: bounded SM107 MLA single-split policy.
f5ec2e580: regression coverage for already-upstream packed-query pruning.
f7dfe6bc7: LDRED for full eligible dense tiles.
b787f5692: request-local dense KV task domains.
525f6750b: preserve original natural FP32 scales in final context/standard-decode statistics, avoiding a rounded base-2 round trip.
a67633fea: use the established FP8 output/L2 contract for the empty-context regression, retain exact empty checks, and tighten active m/s checks.
005d91701: explicitly select the fixed query layout in the new partition-statistics regression; test-only correction.
This is a forward port onto FlashInfer main 3bcec819fc4531ce18591d5ced9e478297212ad8, not a replacement of current main with the older TRT-LLM-pinned wrapper APIs. Main already contains broader packed-query pruning from #6774 (b0920463fdf39834ce2c9e9adee8d3fb863095f9); this PR adds regression coverage instead of duplicating that optimization.
The forward port retains main's scalar softmax_scale/output_scale, independent base-2 LSE, runtime max_q_len/KV bounds, output-quantization slots, and runtime split-capacity handling. Statistics and per-query bounds are appended to those existing callable layouts. Context stores use main's final-LSE row mapping, standard-decode score centering follows main's current SmemP sites, and LDRED retains main's finite mask sentinel and VC scale signature. Request-local dense KV domains clip the runtime launch bound rather than restoring fixed-length specialization.
The original-scale correction retains the natural FP32 scale separately for statistics instead of recovering it from scale * log2(e). Main's existing LSE/output-normalization behavior is retained. The older TRT-LLM-pinned adaptation uses paired natural/base-2 device-tensor overrides, so its source changes and API are deliberately not byte-identical to this main-based implementation.
Supported combinations and limits
Statistics support contiguous/paged prefill, standard decode (including sinks), and dense MLA decode. They can be enabled alongside the existing independent base-2 LSE output. Context statistics reject VC, Sage, and context attention sinks; standard-decode statistics reject Sage. Dense MLA statistics require softmax_rescale_threshold_log2=0. Sparse and NVFP4 MLA surfaces remain unchanged and do not expose this statistics option.
For dense contiguous prefill with statistics, empty per-request K/V segments produce zero output and (-inf, 0) statistics, provided physical K/V storage contains at least one token overall. Paged/causal context statistics require positive K/V lengths. Ordinary decode/MLA zero-K requests retain main's inactive/no-write behavior; explicitly bounded MLA initializes neutral rows, including empty local ranks.
Graph replay uses caller-owned output, statistics, LSE, and metadata buffers with validate=False inside capture. This PR does not claim that host-checking validate=True is capture-safe.
I have installed the hooks with pre-commit install.
I have run pre-commit run --all-files and fixed all reported issues.
All applicable pre-commit hooks passed for each commit; final syntax/diff and clean-source checks passed. Repository-wide hook installation/checks are not claimed when only changed-file checks were run.
🧪 Tests
Tests have been added or updated as needed.
All repository tests are passing.
This PR requires full-scope CI, not targeted tests.
Suggested targeted CI paths for @flashinfer-bot run:
Focused, overlapping CPU selections passed: standard decode/precision 298, MLA bounds plus SM107 policy 111, context contracts 41, shared statistics 42, trace consistency 97, query-pruning contracts 11, LDRED contracts 2, and runtime-KV-domain contracts 13. These phase-specific counts must not be summed as unique tests; GPU skips in local runs are not passes.
The original-scale fix additionally passed focused source/CPU review: 66 upstream and 92 dev CPU cases, with GPU cases skipped locally. The FP8 fixture correction passed seven CPU contract checks executing both fixture bodies with dependency doubles; those are not native GPU qualification.
On Rubin, exact head 005d91701b95e88a3495da84e6d384efccc606d7 passed 104 selected GPU tests with zero skips: context 31, standard decode 38, and MLA 35. Hecate job 927548 used a fresh full-source FlashInfer 0.7.3 package, not a PrimTS overlay on an older installed wheel. This includes all 12 new original-scale regression cases.
The same allocation independently tested the older canonical-dev API adaptation at eef263b: 13 passed, one failed, and seven were not executed. Its original-scale sink case [2-disabled] exposed an approximately 11% denominator error whose exact arithmetic signature is multiplication/subtraction contraction. The dev-only explicit-rounding correction at 069139a65aad98f3e5c61f049c761e28eff0b14e then passed all 21 selected GPU cases with zero skips in Hecate job 927692, without weakening tolerances. The upstream cases above passed unchanged. The first allocation exited with failure and did not time; the follow-up keeps that failure record separate from its successful dev rerun. Downstream TRT-LLM head a7da965b611830fbc1347e84646b687adc177f67, pinning this dev correction, also passed 26 matching-runtime B200 regression checks with zero skips: four native sparse-MLA GPU cases and 22 host/contract cases. This is focused regression coverage, not a full-model rerun. Upstream CI triggering is handled by the maintainer, not this qualification run.
After both correctness gates passed, job 927692 completed 36 fresh-process prepared-wrapper receipts: three ABBA blocks for each of three synthetic cases. Baseline e2203f939e6c95475d7ec609fadfb916c04a2bec and candidate 005d91701b95e88a3495da84e6d384efccc606d7 contain the same original-scale correctness fix; their production delta is only LDRED plus request-local KV domains.

These packed dense FP8 E4M3 cases use H96, Dqk192/Dv128, and BF16 output. B1 uses Q/K lengths 1920/1920 and capacities 2048/2048. B2 uses Q lengths [1664,256], K lengths [0,3840], and capacities Q2048/K4096. Both arms pass actual runtime maxima. All eager, graph, and post-timing numerical checks passed; all input identities were unchanged. Independent audit recomputed 360 raw CUDA-event samples and all nine block summaries. Percentages average paired block ratios; SD is across three blocks in one allocation, not independent allocation replications. This measures prepared-wrapper graph replay only, not native-attention or K3 end-to-end performance. The empty-partition result does not establish its frequency in serving, and statistics ON/OFF changes precision policy as well as output storage.
FP8 empty-context fixture diagnosis
Before changing the output tolerance, nine exact-input controls compared the pre-performance-port source f5ec2e580, the combined source b787f5692, and older dev 76e822974, with and without the empty neighbor and with statistics on/off. All six statistics-enabled active outputs were identical across sources/layouts and exactly matched the BF16-rounded explanatory model that rounds P to E4M3 for PV while retaining the FP32 denominator. The original strict FP32-oracle check missed 2 of 49,920 elements; relative L2 was 2.302%, within the pre-existing expanded-FP8 contract. Empty outputs/statistics and tight active m/s checks passed. This supports the single finite-input fixture correction, not a general hardware-emulator claim or qualification of the subsequent original-scale fix. BF16 thresholds and exact empty checks remain unchanged; the revised FP8 test also requires relative L2 below 5%, active m/s agreement, and a TF32-disabled independent reference.
Downstream evidence and limits
TensorRT-LLM#19395 uses an older canonical-dev API adaptation; its proposed follow-up pin is 069139a65aad98f3e5c61f049c761e28eff0b14e, with downstream validation tracked separately. The completed historical Rubin K3 FP8+MTP DEP16 experiment used pre-rebase TRT-LLM be927b7015 and source-equivalent FlashInfer 30e7ea65/76e822974 kernels, and reached near throughput parity with CuTeDSL plus trtllm-gen: mean paired-block changes of +2.18% at concurrency 128 and +0.56% at concurrency 256, with sample SDs 2.57 and 2.03 percentage points across three blocks. These are pre-rebase, configuration-specific downstream measurements—not fresh full-model results for this main-based FlashInfer head, and not evidence of a robust speedup or output equivalence. The TRT-LLM PR records exact configurations, source provenance, accuracy differences, and scope limits. In that historical DEP16 configuration, native GSM8K scored 96.5125% (1,273/1,319) versus PrimTS 95.8302% (1,264/1,319); both passed the reused 93.2975% gate, but no dedicated FP8+DSpark reference row exists. The nine-answer net gap and exact-text differences remain. The workload used aggregated serving, FP8 target KV/P128, attention DP, TP16/EP16, DSpark5, shared BF16 KDA state/engine prefill, and BF16/P32 drafter KV; it was not the original disaggregated AgentX recipe.
Historical CP8 measurements were prepared-attention/FIFO2 components, not full-model Helix. Strict 8-GPU aggregated full-model Helix was excluded because the scheduler/model does not support that configuration. No KDA behavior or Small-BH NaN fix is shipped by this PR.
The tracking issue names an owner, reason, and graduation plan with a target release.
Core changes are limited to a thin entry point.
Tests live in tests/experimental/ and include a runnable example.
Nothing is registered in flashinfer/aot.py; calling the experimental wrapper remains explicit opt-in.
Shared experimental test scope is declared below.
tests/experimental/test_experimental_api.py
The existing PrimTS implementation and numerical tests remain in flashinfer/attention/prims_ts/ and tests/attention/. This experimental-track scope covers shared opt-in machinery, not kernel correctness; the targeted attention tests above cover the kernels. Backend relocation is outside this change.
Reviewer Notes
Please focus on the exported maximum/denominator merge contract, FP8 normalization, final-row ownership, split-reduction storage and synchronization, per-query bounds, and graph-safe runtime buffer binding. The pinned dev adaptation preserves its older APIs; attribution to this upstream port is not a byte-for-byte equivalence claim or automatic permission to drop adapted commits during a future canonical refresh.
Statistics-enabled centering can change low-precision probability rounding. Enabled and disabled outputs are checked independently against numerical references; bitwise equivalence is not promised. Finite-input correctness tests do not establish isolation from arbitrary nonfinite neighboring storage. Existing variable-window and caller-owned storage-overlap contracts remain applicable.

Walkthrough
PrimTS adds optional softmax maximum and denominator outputs to context, FMHA decode, and MLA decode. MLA decode also adds per-query KV-prefix bounds that replace dense or causal visibility. APIs, kernel paths, reducers, workspace sizing, trace templates, documentation, and tests are updated for these options.
Contiguous and paged context plans accept store_softmax_stats; runs accept compact FP32 output buffers for each query/head. Context kernels calculate and store maximum/denominator pairs. Packed dense non-causal requests can retain empty KV rows for statistics output, and a runtime K-domain policy is selected for a specific SM107 configuration.
FMHA decode statistics and reduction flashinfer/attention/prims_ts/decode.py, flashinfer/attention/prims_ts/kernels/fmha_decode/*, tests/attention/test_attention_ts_decode.py, tests/attention/test_attention_ts_fmha_stats_precision.py
Decode planning and execution accept optional statistics output and account for its scratch space. Kernel paths store partial maxima and denominators, and direct or split-reduction paths produce final row statistics.
MLA plans and runs support statistics output and per-query KV bounds. Bounds are validated and applied as query-specific prefixes; zero-prefix rows receive neutral outputs and statistics. 1CTA and 2CTA paths carry statistics through direct and split reductions. Trace templates and fixtures describe the new options.

The change adds optional softmax statistics output for PrimTS prefill and decode, and it leaves the attention output unchanged. The pre-commit type check currently fails on the trace template. That is a small fix, but it should be done before merge. Three minor documentation and error-message issues are still open and are cheap to resolve.

🎯 Functional Correctness | 🟡 Minor | ⚡ Quick win
Fix the total_k lower-bound error message for statistics-enabled dense plans.
min_total_k is 1 when enable_softmax_stats is set and mask_type == "dense". The ValueError below still says "between batch_size and batch_size * max_kv_len rows". Callers who use the new empty-chunk contract get a wrong lower bound in the message. Put min_total_k in the message.

Include statistics in the shared-memory budget checks.
cluster_reduction_smem_bytes computes the estimate with store_softmax_stats=False, but TmemCorrResource allocates with the runtime statistics flag. The statistics-enabled allocation can therefore exceed the estimate. If a selectable split-KV configuration is close to MAX_CLUSTER_SMEM_DATA_BYTES, the plan can pass validation and then exceed the SM100 shared-memory budget.
Thread store_softmax_stats from launch-spec resolution through estimated_throughput_latency_smem_data_bytes, resolve_auto_cluster_reduction_config, and validate_explicit_cluster_reduction_config. Use the same flag when computing the cluster-reduction footprint. The additional bytes are determined by the split count and row count; they are not always exactly 4 * tile_size_q.

Define the all-empty partition merge.
If every independently computed partition is empty, each statistic pair is (-inf, 0). The documented weight can then evaluate exp(-inf - -inf) * 0 to NaN. State that an all-empty merge returns zero output and (-inf, 0) before calculating weights.

Keep dispatch results aligned with registered templates.
The cached factories treat an omitted store_softmax_stats argument and an explicit store_softmax_stats=False argument as different cache keys. The dispatchers therefore can return a distinct template that is absent from their corresponding _TRACES.values() and .templates lists.
Pass store_softmax_stats=False when building both registries, or omit the argument from dispatch calls when the flag is false.

Add opt-in maximum and denominator outputs to paged prefill, standard decode, and MLA decode while keeping request buffers in run and compile specialization in plan. Preserve direct partial sums and centered score differences for stable statistics, including FP8 probability normalization and split reductions. Add runtime-contract, graph, trace, partition-merge, and precision coverage.

Narrow template.outputs["output"] to Tensor before you read dim_names.
TraceTemplate.outputs has the type Dict[str, Tensor | Scalar]. Scalar has no dim_names attribute. The mypy pre-commit hook fails on Line 1142 with union-attr, and the pre-commit job exits with code 1. Narrow the type explicitly. The narrowing check also gives a clear error if a future template stores a scalar output under "output".

📌 Description
Expose merge-compatible softmax statistics for PrimTS contiguous/paged prefill, paged FMHA decode, and paged MLA decode. Add per-query MLA KV bounds for distributed attention and preserve the independently reviewable, validated MLA scheduling optimizations used by NVIDIA/TensorRT-LLM#19395.
plan(store_softmax_stats=True)selects the compiled specialization;run(softmax_stats=...)binds caller-owned request storage. One-shot entry points and workspace-size helpers follow the same contract. Existing output returns and current-main LSE APIs are preserved.[*out.shape[:-1], 2]and stores(m, s): maximum scaled token logit in natural-log units andsum(exp(logit - m)). Statistics remove internal FP8 probability scaling. Decode sinks contribute once to the denominator without changing the token maximum.(-inf, 0)statistics for supported empty local partitions. Per-query MLA bounds support Helix local attention spans and CUDA-graph replay.Review order and upstream adaptation

3bcec819fc4531ce18591d5ced9e478297212ad8, not a replacement of current main with the older TRT-LLM-pinned wrapper APIs. Main already contains broader packed-query pruning from #6774 (b0920463fdf39834ce2c9e9adee8d3fb863095f9); this PR adds regression coverage instead of duplicating that optimization. The forward port retains main's scalar
softmax_scale/output_scale, independent base-2 LSE, runtimemax_q_len/KV bounds, output-quantization slots, and runtime split-capacity handling. Statistics and per-query bounds are appended to those existing callable layouts. Context stores use main's final-LSE row mapping, standard-decode score centering follows main's current SmemP sites, and LDRED retains main's finite mask sentinel and VC scale signature. Request-local dense KV domains clip the runtime launch bound rather than restoring fixed-length specialization. The original-scale correction retains the natural FP32 scale separately for statistics instead of recovering it from
scale * log2(e). Main's existing LSE/output-normalization behavior is retained. The older TRT-LLM-pinned adaptation uses paired natural/base-2 device-tensor overrides, so its source changes and API are deliberately not byte-identical to this main-based implementation.Supported combinations and limits
Statistics support contiguous/paged prefill, standard decode (including sinks), and dense MLA decode. They can be enabled alongside the existing independent base-2 LSE output. Context statistics reject VC, Sage, and context attention sinks; standard-decode statistics reject Sage. Dense MLA statistics require
softmax_rescale_threshold_log2=0. Sparse and NVFP4 MLA surfaces remain unchanged and do not expose this statistics option. For dense contiguous prefill with statistics, empty per-request K/V segments produce zero output and
(-inf, 0)statistics, provided physical K/V storage contains at least one token overall. Paged/causal context statistics require positive K/V lengths. Ordinary decode/MLA zero-K requests retain main's inactive/no-write behavior; explicitly bounded MLA initializes neutral rows, including empty local ranks.Graph replay uses caller-owned output, statistics, LSE, and metadata buffers with
validate=Falseinside capture. This PR does not claim that host-checkingvalidate=Trueis capture-safe.🔍 Related Issues

Suggested targeted CI paths for
@flashinfer-bot run:Current-head qualification
Focused, overlapping CPU selections passed: standard decode/precision 298, MLA bounds plus SM107 policy 111, context contracts 41, shared statistics 42, trace consistency 97, query-pruning contracts 11, LDRED contracts 2, and runtime-KV-domain contracts 13. These phase-specific counts must not be summed as unique tests; GPU skips in local runs are not passes.
The original-scale fix additionally passed focused source/CPU review: 66 upstream and 92 dev CPU cases, with GPU cases skipped locally. The FP8 fixture correction passed seven CPU contract checks executing both fixture bodies with dependency doubles; those are not native GPU qualification.
On Rubin, exact head
005d91701b95e88a3495da84e6d384efccc606d7passed 104 selected GPU tests with zero skips: context 31, standard decode 38, and MLA 35. Hecate job 927548 used a fresh full-source FlashInfer 0.7.3 package, not a PrimTS overlay on an older installed wheel. This includes all 12 new original-scale regression cases. The same allocation independently tested the older canonical-dev API adaptation at
eef263b: 13 passed, one failed, and seven were not executed. Its original-scale sink case[2-disabled]exposed an approximately 11% denominator error whose exact arithmetic signature is multiplication/subtraction contraction. The dev-only explicit-rounding correction at069139a65aad98f3e5c61f049c761e28eff0b14ethen passed all 21 selected GPU cases with zero skips in Hecate job 927692, without weakening tolerances. The upstream cases above passed unchanged. The first allocation exited with failure and did not time; the follow-up keeps that failure record separate from its successful dev rerun. Downstream TRT-LLM heada7da965b611830fbc1347e84646b687adc177f67, pinning this dev correction, also passed 26 matching-runtime B200 regression checks with zero skips: four native sparse-MLA GPU cases and 22 host/contract cases. Baseline
e2203f939e6c95475d7ec609fadfb916c04a2becand candidate005d91701b95e88a3495da84e6d384efccc606d7contain the same original-scale correctness fix; their production delta is only LDRED plus request-local KV domains. These packed dense FP8 E4M3 cases use H96, Dqk192/Dv128, and BF16 output. B1 uses Q/K lengths 1920/1920 and capacities 2048/2048. B2 uses Q lengths
[1664,256], K lengths[0,3840], and capacities Q2048/K4096. The empty-partition result does not establish its frequency in serving, and statistics ON/OFF changes precision policy as well as output storage.FP8 empty-context fixture diagnosis
Before changing the output tolerance, nine exact-input controls compared the pre-performance-port source
f5ec2e580, the combined sourceb787f5692, and older dev76e822974, with and without the empty neighbor and with statistics on/off. BF16 thresholds and exact empty checks remain unchanged; the revised FP8 test also requires relative L2 below 5%, active m/s agreement, and a TF32-disabled independent reference.Downstream evidence and limits
TensorRT-LLM#19395 uses an older canonical-dev API adaptation; its proposed follow-up pin is
069139a65aad98f3e5c61f049c761e28eff0b14e, with downstream validation tracked separately. The completed historical Rubin K3 FP8+MTP DEP16 experiment used pre-rebase TRT-LLMbe927b7015and source-equivalent FlashInfer30e7ea65/76e822974kernels, and reached near throughput parity with CuTeDSL plus trtllm-gen: mean paired-block changes of +2.18% at concurrency 128 and +0.56% at concurrency 256, with sample SDs 2.57 and 2.03 percentage points across three blocks. The workload used aggregated serving, FP8 target KV/P128, attention DP, TP16/EP16, DSpark5, shared BF16 KDA state/engine prefill, and BF16/P32 drafter KV; it was not the original disaggregated AgentX recipe.Historical CP8 measurements were prepared-attention/FIFO2 components, not full-model Helix. Strict 8-GPU aggregated full-model Helix was excluded because the scheduler/model does not support that configuration. No KDA behavior or Small-BH NaN fix is shipped by this PR.
🔬 Experimental Track
tests/experimental/and include a runnable example.flashinfer/aot.py; calling the experimental wrapper remains explicit opt-in.The existing PrimTS implementation and numerical tests remain in
flashinfer/attention/prims_ts/andtests/attention/. This experimental-track scope covers shared opt-in machinery, not kernel correctness; the targeted attention tests above cover the kernels. Backend relocation is outside this change.Reviewer Notes
