feat: estimate speculative decode from STP FPM using draft length - #630
The fixed rule is T_SD,iter = (0.08*d + 1.25) * F_STP((d+1)*B, K_total). For d=3, the estimator queries STP at 4*B, preserves the exact total past KV, and multiplies the result by 1.49 once. The result includes draft and verification, before any accepted-token throughput projection.
The same rule applies to every ordinary STP interpolation, regression and learned FPM, without a model/GPU allowlist, SD algorithm selection or draft checkpoint. The selected estimator's normal support/readiness requirements still apply at the widened coordinates. Detailed results keep the original STP evidence under stp_reference, separate from the estimated SD latency and multiplier.
draft_length is a positive integer required for an SD query; omitting it preserves STP behavior and the existing result schema. This is a per-query prediction API: model configuration, tuning and memory accounting stay STP. It does not introduce a replay executor or CLI deployment switch. V1 supports pure decode, including idle ranks; prefill/mixed requests, op-level/hybrid estimators and already-measured SD-round models are rejected to prevent unsupported composition or double counting.
Review map
Risk level: medium (new empirical prediction path).
Start with crates/core/src/perfmodel/fpm/speculative.rs for the reference workload mapping, then the model methods and Python facade.
Public contract: optional keyword-only draft_length on the scalar/detailed Python query methods; explicit Rust speculative-query methods and result type. No serialized engine/config schema change.
Compatibility: existing calls are unchanged. The configured estimator must remain STP; existing nextn/measured-SD configurations are not rescaled. Learned/regression tuning still consumes STP observations.
Evidence
Local validation at dce365ac6c6e53e224a3a9392601ce4651b11514:
cargo test -p aisimulate-core --lib perfmodel::fpm:: — 333 passed.
cargo test -p aisimulate-core --lib speculative_scaling_rejects_a_measured_round — 1 passed.
Independent numerical oracles: synthetic STP B=8,K=64 is 8 ms, so logical B=2,d=3 is 11.92 ms while the evidence remains 8 ms; Python multi-rank tests use hand-authored B + K_total/1024 timing surfaces at all four measured depths.
Fast CI / Full CI: see checks at the current head.

Review follow-up validation at d04fdb4ded3d3d6f292d8c03ea4f7f6d129bfb73:
Both new native-stub contract cases failed before the stub fix, then passed with matching parameter names, kinds, defaults, annotations and return types.
Ruff, documentation-link checks, copyright and strict CODEOWNERS coverage passed. No estimator math changed.
This is an empirical whole-iteration approximation, not newly measured SD data. The coefficients are fixed; there is no runtime fitting. The comparison below is the study's repetition-1 MAPE against a frozen repetition-0 measured STP reference, so it excludes actual FPM prediction error.

Across 192 configurations / 18,836 validation rounds: 8.08% round-weighted MAPE, 7.33% equal-configuration MAPE, 18.19% P90, 31.53% worst-configuration MAPE. These are descriptive errors, not confidence bounds or an accuracy guarantee for every supported model.
Protocol 5: TP1 BF16, top-k 1, draft lengths 1–4, batches 1/4/8, initial contexts 1024/4096, two repetitions and 256 generated tokens. Offload, overlap scheduling and radix cache were disabled. The CUDA interval brackets the complete model-worker forward call (including possible launch gaps), excluding prefill and scheduler work outside it. The first 16 rounds and unsupported/non-graph observations were excluded by the original analyzer; no error-based trimming was used.
One model per method confounds model and method effects. Hopper MTP used FlashInfer and Blackwell MTP used TRT-LLM MHA; EAGLE3 used FlashInfer across both. Wider depth/model/workload coverage is extrapolation. The study data were inspected during prior analyses, not a new blind validation.

Scaling and calibration: The estimate applies 1.25 + 0.08 * draft_length to an STP estimate at (draft_length + 1) * batch_size. The reported calibration excludes actual FPM prediction error, so it does not establish end-to-end accuracy.
Eligibility and readiness: Queries require pure decode and estimator support and readiness at the widened coordinates. The implementation rejects prefill or mixed work and invalid request-count overflow. The documented contract also excludes operation-level, hybrid, and already-measured SD-round estimators.
Public API contract: Rust and Python query APIs add optional draft_length. Omitting it preserves existing STP behavior and result schema. Detailed results include the unscaled STP reference, scaling factor, and draft length.
Changed behavior and contracts
Rust adds estimate_speculative_forward_pass_time_ms and estimate_speculative_forward_pass_detailed. Python bindings and SDK methods accept keyword-only draft_length.
Reference metrics widen decode request counts by draft_length + 1. When per-request KV lists are present, the implementation splits each KV length across the widened requests and distributes integer remainders without dropping tokens. The returned detail retains the original STP estimate and evidence.
The documented rule estimates a complete SD decode iteration, including draft and verification. It is not verification-only or time per accepted token.
Configuration, tuning, and memory accounting remain STP. V1 supports pure decode, including idle ranks.
Evidence supplied
The author reports 333 FPM tests passed, one measured-round rejection test passed, and 305 Python tests passed. The author also reports Ruff, formatting, legal consistency, CODEOWNERS, and documentation-link checks passed. These results were not independently verified.
The reported study covers 192 configurations and 18,836 validation rounds. It reports 8.08% round-weighted MAPE, 7.33% equal-configuration MAPE, 18.19% P90, and 31.53% worst-configuration MAPE. These are descriptive errors, not confidence bounds or accuracy guarantees.
Source inspection confirms the documented scaling rule, pure-decode validation, widened request count, KV-preserving split, and detailed-result fields.
Evidence still missing
Fast CI and Full CI results are not stated.
Current review findings were not supplied. Severity counts are unavailable. Bot review is not treated as approval.
Technical quality: Supplied change summaries, reported tests, and inspected source cover scaling, validation, input immutability, rejection cases, and preservation of existing query behavior.
Merge readiness: Cannot be determined from the supplied evidence. CI results and current review findings remain unavailable.
The FPM model now estimates speculative forward-pass latency from widened decode metrics and a scaled STP reference. Rust and Python query APIs accept an optional draft length and return detailed estimate fields.
The new estimate type records optional latency, draft length, scaling factor, and STP reference. The metric transformation widens decode request counts, preserves total past-KV lengths, and rejects invalid metrics.
Validate and integrate speculative estimates crates/core/src/perfmodel/fpm/model.rs, crates/core/src/perfmodel/engine/runtime.rs, crates/core/src/perfmodel/fpm/tests.rs, crates/core/src/perfmodel/mod.rs, crates/core/src/lib.rs
The model validates estimator provenance, estimates the widened STP reference, and scales available latency. Tests cover estimator paths and rejection of measured full-round engines.
Python query methods accept keyword-only draft_length and retain the standard path when it is omitted. Tests and documentation cover input validation, supported work, result fields, API signatures, and calibration limits.
The speculative query APIs and documentation are consistent, and the calibration evidence is available in the repository. No merge-blocking risk remains.

Full details: Modeling And Data Evidence
Explanation
The PR supplies both provenance and reproducible numerical evidence. benchmarks/evidence/sd-fpm-depth-v1/README.md documents the protocol, validation/repetition split, exclusions, aggregate and per-cell MAPE values, study revision, and SHA-256 dataset hashes (lines 8-32, 54-74). The added Rust tests use hand-authored expected values for widening, KV preservation, STP references, and one-time factors (for example 28.2 and 11.92 in crates/core/src/perfmodel/fpm/tests.rs:2535-2638). The Python tests use an explicit synthetic latency surface and verify ordinary before/after behavior plus factors for depths 1-4 in python/aisimulate/tests/unit/sdk/test_fpm_forward.py:385-419. The SVG is supplemental; validation is not binary-only, and no unexplained golden refresh is present.
Full details: Compatibility Boundaries
Explanation
The prior stub mismatch is addressed. The reviewed head declares draft_length: int | None = None as keyword-only on both native methods in python/aisimulate/src/aisimulate_core/_native.pyi:205-206. The added contract test compares stub parameter names, kinds, defaults, annotations, and returns with the native binding in python/aisimulate/tests/cross_package/test_core_public_api.py:520-545. The Rust binding and SDK facade use the same keyword-only option (crates/core/src/perfmodel/py.rs:2435-2474, python/aisimulate/src/aisimulate_core/sdk/rust_engine_step.py:679-729), and the Python documentation records the same default and result behavior. Existing calls retain the no-argument path. The PR changes no package manifests, dependency declarations, versions, or serialized configuration schemas. The existing unified-wheel checks still require one aisimulate wheel containing _native.pyi and reject split core distributions (python/aisimulate/tools/verify_release_wheels.py:162-217, python/aisimulate/tools/verify_installed_package_layers.py:51-80). The downstream Dynamo caller continues to use the compatible one-argument form (ai-dynamo/dynamo at commit 261a106a3d58cdb770604f816752e0688505fb71, components/src/dynamo/planner/core/perf_model/engine_query.py:608-625), and AISimulate remains a separately published crate dependency (same commit, Cargo.toml:62-63). Prior failure addressed: The head updates _native.pyi with keyword-only draft_length on both methods and adds a native/stub signature contract test at python/aisimulate/tests/cross_package/test_core_public_api.py:520-545.
Full details: Description check
Explanation
The pull request description covers the problem, behavior change, review map, public API contract, compatibility, test evidence, boundary cases, numerical derivation, and modeling provenance. The optional Tracking section with Closes and Related PRs is missing, but the description is otherwise complete and actionable.
Full details: Cross-Layer Contract
Explanation
The stale stub and documentation claims are resolved: _native.pyi now declares keyword-only draft_length (lines 205-206), the Python API and configuration docs describe the input and detailed output, and SDK tests cover scaling and detailed fields (python/aisimulate/tests/unit/sdk/test_fpm_forward.py:404-464). The raw PyO3 behavior remains without a direct test. crates/core/src/perfmodel/py.rs:2435-2474 adds both raw methods and JSON output, but python/aisimulate/tests/cross_package/test_core_public_api.py:520-546 only compares signatures and stub AST. The behavioral test calls the SDK wrapper, not aisimulate_core._native.RustForwardPassPerfModel directly. This leaves the changed raw public consumer contract insufficiently tested.
Resolution
Add a cross-package or unit test that imports aisimulate_core._native.RustForwardPassPerfModel, constructs a minimal STP model, calls both raw methods with JSON input and draft_length, and asserts the scalar result plus json.loads() of the detailed result, including latency_ms, draft_length, scaling_factor, and stp_reference. Retain the existing stub-signature and SDK tests.
Full details: Review Evidence
Explanation
The visible description names local commands and results, and it lists negative and boundary validation. However, the description is explicitly truncated, so the required provenance distinctions for fake-runner, parity, and production evidence cannot be verified. The visible “Fast CI / Full CI: see checks at current head” statement also does not provide hosted results or prove an active exact-head run. Repository policy shows Fast CI is PR-triggered, while Full CI is triggered by manual dispatch or trusted push branches and its reusable jobs are conditional (.github/workflows/fast-ci.yml:3-12; .github/workflows/ci.yml:8-22, 236-257).
Resolution
Provide the complete PR description and exact hosted check results for the reviewed SHA. Label local tests, fake-runner results, parity results, and production or hardware evidence separately. Do not cite reusable or inactive nested workflows as hosted CI evidence.

Dynamo’s Planner still calls the estimator with only serialized FPM metrics; no draft_length is supplied. [::ai-dynamo/dynamo::components/src/dynamo/planner/core/perf_model/engine_query.py:615-629]
Dynamo’s AIS session similarly exposes only its existing static query path and rejects speculative nextn workloads for FPM interpolation. [::ai-dynamo/dynamo::lib/bindings/python/src/dynamo/_internal/ais.py:145-163]
Runtime speculative handling separately packs nextn + 1 into verification batch metrics before calling the ordinary estimator. This boundary should not be combined with the new draft_length scaling, or scaling could be applied twice. [::ai-dynamo/dynamo::lib/bindings/python/rust/llm/ais_callback.rs:53-81]
Dynamo’s Rust callback explicitly rejects speculative FPM interpolation for nonzero nextn, aligning with the PR’s ordinary-STP-only restriction. [::ai-dynamo/dynamo::lib/bindings/python/rust/llm/ais_callback.rs:167-175]
ai-dynamo/aiconfigurator
The frozen Python facade still defines estimate_forward_pass_time_ms(metrics) with no speculative argument; linked consumers using this facade will not automatically gain draft_length support. [::ai-dynamo/aiconfigurator::aic-core/src/aiconfigurator_core/sdk/rust_engine_step.py:208-221]
The native Rust binding likewise accepts only one FPM iteration JSON argument. [::ai-dynamo/aiconfigurator::aic-core/rust/aiconfigurator-core/src/py.rs:1418-1429]
AIC’s existing speculative contract models configured nextn and nextn_accepted as an upper-layer acceptance/progress projection, distinct from the new per-query STP scaling API. [::ai-dynamo/aiconfigurator::src/aiconfigurator/sdk/speculative.py:4-9][::ai-dynamo/aiconfigurator::src/aiconfigurator/sdk/speculative.py:28-50]
The frozen compatibility documentation requires deprecation/version handling for adding required facade parameters; the PR’s keyword-only optional argument preserves the existing call shape. [::ai-dynamo/aiconfigurator::aic-core/API.md:243-253]

Reviewed dce365a. The widened STP reference preserves total past KV, applies the empirical multiplier once after the existing estimator/correction path, and keeps STP evidence separate. I found no P0/P1 correctness issue in the reviewed paths. Approving with one non-blocking P2 typing-contract follow-up inline.
Python FPM/engine-step/speculative-identity suites: 305 passed using a freshly built native extension.
Additional synthetic probes passed for per-request learned features, selected-feature regression, input immutability, and snapshot restoration.
The shipped stub mismatch was reproduced with mypy for both query methods.
Fast CI and Full CI are successful on this head. This review does not add GPU predictive-accuracy evidence; the documented calibration and extrapolation limits still apply.

Why and what changed
An STP FPM can now estimate a complete speculative decode iteration by supplying
draft_lengthon the existing prediction API:The fixed rule is
T_SD,iter = (0.08*d + 1.25) * F_STP((d+1)*B, K_total). Ford=3, the estimator queries STP at4*B, preserves the exact total past KV, and multiplies the result by 1.49 once.
