Dev Engineer Review

The HALO-Q kernel adds register-resident planning, scheduled quota repair, and warp-based helper coloring for supported sizes. It retains fallback paths and the existing planner path for EP≤8. Reported performance gains and plan-matching results are author-reported. Test execution results and current review findings were not supplied.

QA Engineer Review

The changes add a HALO-Q planner CUDA unit test and a four-GPU per-layer dynamic EPLB test. The planner test checks invariants and golden outputs across eight configurations. The integration test checks reference outputs, route placement, copied expert weights, helper-slot use, and shutdown behavior. Both tests are listed in test-db/: the planner test on B200 and GR100, and the EPLB test on GB200 and GB300. Test execution status is unavailable. Coverage verdict: needs follow-up.

Per-File QA Perspective

  • cpp/tensorrt_llm/kernels/moe/loadBalance/dynamicEplb/moeRebalanceHaloQKernel.cuh: Verify the new register-based planning, quota-pair scheduling, and helper-coloring paths across supported sizes and their fallbacks.
  • cpp/tests/unit_tests/kernels/moe/moeRebalanceHaloQTest.cu: Covers seeded routing cases, plan and quota invariants, and golden plan, quota, and coloring outputs. The integration test runs this test for architectures "100" and "107".
  • cpp/tests/unit_tests/kernels/CMakeLists.txt: Registers the HALO-Q GPU unit-test target. Verify the target builds and runs in the C++ unit-test workflow.
  • tests/integration/defs/cpp/conftest.py: Adds an architecture-specific standalone-build fixture for the HALO-Q test target.
  • tests/integration/defs/cpp/test_unit_tests.py: Adds test_haloq_planner_unit_tests for architectures "100" and "107", with JUnit output.
  • tests/integration/test_lists/test-db/l0_b200.yml: Adds the architecture-100 HALO-Q planner test to the B200 CI list.
  • tests/integration/test_lists/test-db/l0_gr100.yml: Adds the architecture-107 HALO-Q planner test to the GR100 CI list.
  • tests/unittest/_torch/moe/test_per_layer_dynamic_eplb_gpu.py: Adds test_per_layer_dynamic_eplb_megamoe_cutedsl, which covers three forwards, reference outputs, route placement, expert-weight copies, helper-slot use, and shutdown. Listed in the GB200 and GB300 multi-GPU CI lists.
  • tests/integration/test_lists/test-db/l0_gb200_multi_gpus.yml: Adds the per-layer dynamic EPLB test to the GB200 multi-GPU CI list.
  • tests/integration/test_lists/test-db/l0_gb300_multi_gpus.yml: Adds the per-layer dynamic EPLB test to the GB300 multi-GPU CI list.

Description

Follow-up to #19646. The planner CTA of the HALO-Q fused kernel was slow above EP8. Its EP>8 paths had three costs:

  • they kept rank state in shared memory;
  • they walked group ranks serially;
  • they ran every tournament phase of the quota repair behind a full-block barrier.

As a result, planning at EP16 and EP32 took about 9x and 28x as long as at EP8. This PR rewrites those paths. Every output stays bit for bit the same: plans, pre- and post-repair quotas, and helper-slot coloring.

  • Placement (plan_halo_m_warp):
    • Lane = rank, with all state in registers, and every choice made with a redux.sync key.
    • Each lane keeps its groups' rooms, updated as ranks receive.
    • Each level's two emptiest members are found beside the owner choice.
    • Ranks that would be frozen are left out of the owner choice instead of costing an iteration.
  • Prepare: homes of at most 32 experts rank their experts in parallel.
  • Repair (at most 32 broadcasts):
    • Pairs that share fewer than two broadcasts are dropped, since they never move quota.
    • The remaining pairs run in dependency steps, so each rank keeps the tournament's order.
    • A scheduler warp computes the steps ahead into a small shared-memory region of its own.
    • Up to 14 warps run the pairs, with an early exit for pairs that cannot move quota.
  • Coloring: warp 8 assigns helper slots with one lane per broadcast.

The new paths work for any EP up to 32, including 6, 12 and 24, and for any expert count. EP <= 8 keeps its existing 8-lane paths. The kernel change touches one file, moeRebalanceHaloQKernel.cuh; the other changed files add the tests listed below.

Planner microbenchmark (one CTA, three helper slots, placement + repair medians on routing traces):

  • EP12, 16, 24 and 32 plan 4.5x, 6.6x, 7.1x and 14x faster.
  • EP6 and EP8 are unchanged.
  • Coloring at EP32 is about 4x faster.

Simulation of rank balance (Python model of the planner; DeepSeek-V4-Pro prefill routing, 8,192 tokens per rank; slots = helper slots per rank; imbalance ratio R = max / mean rank load, averaged over rounds and the 61 MoE layers; this PR keeps #19646's plans):

SciCode 1.0996 1.0221 1.0296 1.0041

The follow-up (not in this PR) adds aligned 2-rank groups that the owner rank fills with direct unicast writes, so only the rank that takes tokens holds a copy, and picks each group by the helper slots it costs.

Test Coverage

  • Standalone planner bench, against the previous kernel and a Python reference:
    • 32 configurations: EP3-EP32, 3-40 helpers, 96 and 384 experts, generic fallbacks included.
    • Plans, pre- and post-repair quotas and coloring outputs are bit-identical.
    • 100 repeated runs per configuration reproduce them bit for bit.
  • End to end (DeepSeek-V4-Pro, DEP8): GSM8K accuracy unchanged, and context-only throughput shows no regression against the previous kernel. This ran on an earlier revision of this change that differs only in where the repair schedule is stored.
  • New unit test cpp/tests/unit_tests/kernels/moe/moeRebalanceHaloQTest.cu (single GPU; CI builds only this gtest and runs it on B200 pre-merge and GR100 post-merge, and other GPUs skip it):
    • One CTA runs the whole planner (prepare, placement, quota repair, per-rank coloring) on 8 seeded inputs: EP4-EP32, 96 and 384 experts, every repair and coloring path.
    • Checks plan validity, quota conservation before and after repair, unchanged per-rank load through repair, no rise in the maximum rank load, conflict-free helper slots and per-rank outputs that match the plan.
    • A golden hash pins the full output.
  • New multi-GPU test tests/unittest/_torch/moe/test_per_layer_dynamic_eplb_gpu.py (4 GPUs; GB200 pre-merge and GB300 post-merge, skipped without NVLink multicast):
    • One MoE layer built through create_moe with per-layer dynamic EPLB on MegaMoE CuteDSL runs three forwards whose routing piles onto one rank's experts: a fresh plan, the same plan with its helpers already resident, and a different plan.
    • Each rank checks the output against the NVFP4 reference, that every route lands on its expert's home slot or on a helper slot holding a byte-exact copy of that expert's weights in all seven planes, and that helper slots were used.
  • Existing tests: tests/unittest/_torch/moe/test_per_layer_dynamic_eplb.py and tests/unittest/_torch/moe/test_dynamic_eplb_contracts.py.

Walkthrough

The kernel updates HALO-M preparation and planning, generalizes HALO-Q repair, and adds scheduled repair and warp-based helper coloring. New CUDA and integration tests cover planner behavior and per-layer dynamic EPLB execution.

Changes

Dynamic EPLB planning and repair

Layer / File(s) Summary
HALO-M preparation and warp planning
cpp/tensorrt_llm/kernels/moe/loadBalance/dynamicEplb/moeRebalanceHaloQKernel.cuh
Homes with at most 32 experts use per-expert ranking by descending mass, with local index breaking ties. The register-resident planner tracks rank groups, capacity, receiver slots, candidates, quotas, and rank loads. It selects active lanes and reduction key width based on EP size and total load.
HALO-Q pair repair and scheduling
cpp/tensorrt_llm/kernels/moe/loadBalance/dynamicEplb/moeRebalanceHaloQKernel.cuh
Pair-repair reductions and scans support configurable lane counts. For up to 32 broadcasts, warp 15 schedules ordered pair steps in scratch for other warps to execute. Schedule scratch is included in allocation and shared-memory sizing.
Warp-based helper coloring
cpp/tensorrt_llm/kernels/moe/loadBalance/dynamicEplb/moeRebalanceHaloQKernel.cuh
For up to 32 broadcasts and 1–32 helpers, the warp path assigns the lowest available helper slot to each broadcast and records slot errors. Other cases use the lane-0 path.
Planner validation and test integration
cpp/tests/unit_tests/kernels/moe/moeRebalanceHaloQTest.cu, cpp/tests/unit_tests/kernels/CMakeLists.txt, tests/integration/defs/cpp/*, tests/integration/test_lists/test-db/*
The CUDA test checks planning, quota validity and conservation, load preservation, helper coloring, and expected output hashes across eight cases. Integration fixtures build and run it for architectures 100 and 107.
Per-layer EPLB end-to-end test
tests/unittest/_torch/moe/test_per_layer_dynamic_eplb_gpu.py, tests/integration/test_lists/test-db/l0_gb200_multi_gpus.yml, tests/integration/test_lists/test-db/l0_gb300_multi_gpus.yml
A four-GPU test runs three skewed-input forwards with MegaMoE CuteDSL and NVFP4. It checks output against a reference MoE, validates routes and helper weight slots, and confirms balancer shutdown. The test is registered in the GB200 and GB300 test lists.

Full details: Description check

Explanation

The PR description follows the repository template closely. It has a Description section that states the problem (EP>8 planner slowness from shared-memory rank state, serial group-rank traversal, and full-block barriers), the solution (register-resident placement, per-expert prepare for homes of at most 32 experts, dependency-stepped pair repair, and warp-parallel coloring), and the measured effect (4.5x to 14x planner speedups for EP12 to EP32, bit-identical outputs). The Test Coverage section lists the standalone planner bench, the end-to-end DeepSeek-V4-Pro DEP8 run, the new single-GPU gtest moeRebalanceHaloQTest.cu, the new four-GPU test test_per_layer_dynamic_eplb_gpu.py, and the existing EPLB tests. The PR Checklist is retained but unchecked, which the template allows. Minor gaps: the template's PR title format is not stated in the description body (the title is outside the description), the checklist items such as API label, CODEOWNERS, and documentation status are not addressed, and the end-to-end run was done on an earlier revision that differs only in repair-schedule storage, which the author does disclose. The description is mostly complete, so the check passes.

Explanation

Docstring coverage is 45.45% which is insufficient. The required threshold is 80.00%. Docstring coverage is scoped to functions touched by this diff with cyclomatic complexity of at least 2. Documentation-only edits and deletions within surviving functions are included; unchanged diff context and fully deleted functions are excluded. Analyzed 11 functions across 4 files. …ly pairs that can move quota

The planner CTA's EP>8 paths kept rank state in shared memory, walked
group ranks serially and ran every tournament phase of the quota repair
behind a full-block barrier, so planning took about 9x and 28x as long at
EP16 and EP32 as at EP8. Every output stays bit for bit the same.

- Placement (plan_halo_m_warp): lane = rank with all state in registers,
owner/group/destination choices as redux.sync keys, group rooms kept per
lane and updated as ranks receive, each level's two emptiest members found
beside the owner choice, and ranks that would be frozen (no candidate
left, an empty one, no qualifying group; all final) left out of the owner
choice instead of costing an iteration. Compile-time warp masks.
- Prepare: homes of at most 32 experts rank their experts in parallel.
- Repair with at most 32 broadcasts: pairs sharing fewer than two
broadcasts are dropped (they never move quota) and the rest run in
dependency steps -- a pair once neither rank has an earlier pair left --
so ranks keep the tournament's order. Warp 15 computes the steps ahead
into kScheduleInts ints of their own at the end of the planner's shared
memory, so the path holds for any expert count; up to 14 other warps
(never warp 8) run the pairs, returning early when neither direction can
move quota. run_halo_q takes that region as a new argument.
- Coloring: warp 8 assigns helper slots with one lane per broadcast when
there are at most 32 broadcasts and 32 helpers.

None of it assumes a power-of-two EP; EP <= 8 keeps its 8-lane paths.

On the planner microbenchmark (one CTA, three helper slots, placement +
repair medians on routing traces), EP12, 16, 24 and 32 plan 4.5x, 6.6x,
7.1x and 14x faster and EP6/EP8 are unchanged, with 96 or 384 experts;
coloring at EP32 is about 4x faster. Plans and pre-/post-repair quotas
equal the previous kernel in 32 configurations (EP3-EP32, 3-40 helpers,
96 and 384 experts, generic fallbacks included), as do the coloring
outputs for local ranks 0, ep/2 and ep-1, and 100 repeated runs of each
reproduce them bit for bit.

Rename optin to pass the configured codespell hook.

The codespell hook can reject optin, which prevents the Release Checks / Pre-commit Check job from passing. Use a descriptive name that is not flagged.

The per-layer dynamic EPLB tests run on CPU only, so no CI test executed
the planner kernel. moeRebalanceHaloQTest runs placement, quota repair
and helper-slot coloring on routing counts given to one CTA, without the
cross-rank count exchange or the copy, so it needs one GPU. HALO-Q runs
on Blackwell and Rubin only, so the test skips other GPUs, and CI builds
just this gtest and runs it on B200 (pre-merge) and GR100 (post-merge),
sharing the single-target build of the KV cache compression test.

Eight inputs cover EP4 to EP32 (including EP12), 96 and 384 experts, the
8-lane and 32-lane planners, the pair and scheduled repairs, more than 32
broadcasts and more than 32 helpers. Each case checks the plan's
invariants -- valid groups and owners, quota rows that add up to the
expert's tokens on its hosts only, a repair that keeps every rank's load,
a placement that never raises the busiest rank, conflict-free helper
slots and each rank's slot table -- and pins the exact plan by a hash.

No GPU test ran the per-layer dynamic EPLB data path: HALO-Q exchanging
the routing counts and planning the hot experts, the in-switch copy of
their weights into helper slots, and MegaMoE computing on the remapped
routes. test_per_layer_dynamic_eplb_gpu.py builds one MoE layer through
create_moe on four EP ranks and runs three forwards whose routing piles
onto one rank's experts: a fresh plan, the same plan with its helpers
already resident, and a different plan. After each forward every rank
checks the output against the NVFP4 reference, that each route lands on
its expert's home slot or on a helper slot holding a byte-exact copy of
the expert's weights in every plane, and that some routes used helper
slots.

The path needs NVLink multicast and fabric memory handles, so the test
is listed for GB200 (pre-merge) and GB300 (post-merge); GPUs without
them skip it.

Nitpick Check that the repeated forward reuses resident helper weights.

Check that the repeated forward reuses resident helper weights.

The first two forwards use the default per_layer_resident mode with identical inputs. The current output and slot-weight checks can still pass if the second forward copies every helper weight again. Add a behavior-level copy-scheduling signal that proves already-resident helpers are not recopied.
